PagedAttention is a GPU memory management technique that improves efficiency during large language model (LLM) inference. It works by dividing the Key-Value (KV) cache into smaller, reusable memory pages instead of reserving large, contiguous memory blocks. This method reduces memory waste, fragmentation, and operational costs while enabling faster and more scalable inference.

PagedAttention is particularly useful for handling dynamic tasks, large context windows, and advanced scenarios like beam search or parallel sampling. It’s a practical solution for improving LLM performance without requiring expensive hardware upgrades.

handle text efficiently. When generating text, these models rely on previously processed tokens to maintain context and coherence. Without a KV cache, the model would have to repeatedly recalculate attention weights for every token, which would be computationally expensive.

You can think of the KV cache as the model's

. For each token in the input, the transformer generates key and value vectors that encapsulate important details about the token's meaning and role. These vectors are stored in the cache, allowing the model to quickly retrieve them when processing the next tokens.

, which means they reserve a single, continuous block of GPU memory for each request. This is similar to booking an entire row of seats at a theater, even if only a few seats are actually needed. The system allocates memory based on the maximum sequence length, which often leads to wasted resources when the actual sequences are shorter than the allocated space.

This issue becomes even more pronounced with modern LLMs that support massive context windows of 32,000 tokens or more. A single request might reserve enough memory for the entire context window but end up using only a fraction of it. Meanwhile, other requests are left waiting for available memory, creating inefficiencies.

PagedAttention addresses this inefficiency with a fresh approach to memory allocation.

Building on the foundation of the KV cache, PagedAttention introduces a smarter way to allocate memory. Instead of reserving one large block, it breaks the KV cache into smaller, fixed-size units called

Each KV block typically stores the key and value vectors for a small group of tokens, often 16 tokens per block. This modular setup allows memory to be allocated according to the actual sequence length, avoiding the waste associated with reserving space for the maximum possible length.

(or page table) acts as the system’s memory map, keeping track of which physical memory blocks belong to each request. When a request needs to access its KV cache, the block table translates logical positions in the sequence into actual memory addresses. This layer of indirection enables advanced optimizations like memory sharing and dynamic allocation.

oversees block allocation and sharing across multiple requests. For example, if two requests share a common prefix - such as the same system prompt - the scheduler can allow them to share memory blocks for that prefix. Freed blocks can also be reallocated immediately to new requests, ensuring efficient use of available memory.

This architectural shift paves the way for the optimizations discussed below.

PagedAttention’s approach to KV cache allocation not only saves memory but also enables faster, more scalable inference. By using

, it eliminates the need for all KV cache data to occupy adjacent memory locations. This is similar to how files on a hard drive can be scattered across different sectors without impacting functionality.

, which is a common problem in traditional systems. The memory savings become especially noticeable when handling multiple requests with varying sequence lengths.

is another significant advantage. For example, if multiple requests include the same system prompt or conversation history, PagedAttention allows them to share the same physical memory blocks. This is achieved through a copy-on-write mechanism, where identical content is stored only once.

with ease. As a request generates more tokens and requires additional KV cache space, it simply allocates new blocks and updates the block table. There’s no need to move existing data or reallocate large chunks of memory, making the system more responsive and reducing fragmentation over time.

, PagedAttention excels by sharing prefix blocks across multiple candidate sequences. Separate memory blocks are only allocated for the portions of the sequences that diverge. This approach can cut memory usage by 50% or more, making complex generation strategies feasible even on standard hardware setups.

PagedAttention brings significant advantages by improving how memory is utilized in

(LLMs). With its ability to minimize memory waste - leaving just about 4% unused

 - it ensures nearly optimal use of KV caches. This means systems can handle more sequences in a single batch, leading to higher throughput and lower operational costs. The result? Faster, more cost-effective LLM performance, making it a game-changer for production environments where efficiency matters.

These memory optimizations open the door to better handling of diverse input lengths and dynamic tasks. Developers can scale up LLM workflows and enhance performance in settings where managing resources effectively is crucial. From processing extensive datasets to running complex, dynamic queries, PagedAttention enables smoother, more efficient operations across various applications.
